Diffusion-based Vision-Tactile Policy Learning with Uncertainty-Aware Modality Scheduling for Contact-Rich Robotic Manipulation Tasks

Contact-rich robotic manipulation, such as precision assembly and intricate tool use, requires the seamless integration of visual and tactile feedback. Traditional policies often struggle with dynamic modality reliability, where vision suffers from severe occlusions during close-proximity interactions, and tactile sensing becomes uninformative when the end-effector breaks contact. To address these limitations, this paper introduces a novel framework integrating diffusion-based policy learning with an uncertainty-aware modality scheduling mechanism. We conceptualize action generation as a conditional denoising diffusion process, which intrinsically captures multimodal action distributions and mitigates the compounding errors typical of deterministic behavior cloning. Furthermore, we propose an adaptive scheduling mechanism that continuously evaluates the epistemic and aleatoric uncertainties of the vision and tactile encoders. By dynamically reweighting the contributions of each modality based on their real-time predictive confidence, the system seamlessly transitions from vision-dominant pre-contact phases to tactile-dominant manipulation phases without relying on hard-coded heuristics. Extensive evaluations in complex manipulation tasks, including tight-tolerance peg-in-hole insertion and contour following, demonstrate that our approach significantly outperforms existing multimodal fusion baselines. The dynamic scheduling prevents catastrophic failures caused by noisy sensory inputs, thereby improving overall task success rates and sample efficiency. This research provides a robust foundation for deploying generalist robotic agents in unstructured, contact-rich environments.
